What is AI bias?

AI bias refers to systematic and unfair errors in artificial intelligence systems that lead to unequal or inaccurate outcomes for certain individuals or groups. It occurs when an AI model produces results that favor or disadvantage people based on characteristics such as race, gender, age, socioeconomic status, or health conditions, often without explicit intent.

 

How AI bias happens

AI bias typically arises from one or more of the following:

  • Biased training data: If the data used to train an AI system reflects historical inequalities, underrepresents certain groups, or contains human prejudices, the model can learn and reproduce those biases.
  • Data gaps or imbalance: When certain populations are missing or poorly represented in datasets, AI systems may perform worse for those groups (e.g., diagnostic tools trained mostly on data from one demographic).
  • Design and development choices: Decisions about what features to include, how outcomes are defined, or which metrics are optimized can unintentionally embed bias.

Types of AI bias

  • Selection bias: Selection bias occurs when the training data isn’t representative of the population the AI will serve. If key groups are underrepresented in the dataset, the model’s predictions may be inaccurate or discriminatory.
  • Confirmation bias: Confirmation bias emerges when an AI system reinforces existing patterns in the data, effectively perpetuating historical prejudices. 
  • Measurement bias: Measurement bias happens when the data collected doesn’t accurately reflect the true variables the model is trying to predict. 
  • Stereotyping bias: Stereotyping bias occurs when AI systems reproduce or amplify harmful stereotypes. 
  • Out-group homogeneity bias: Out-group homogeneity bias causes AI to treat members of underrepresented groups as more alike than they actually are. In practice, this might show up in facial recognition systems struggling to differentiate among individuals from racial or ethnic minorities, potentially contributing to misclassification and discriminatory practices.

 

How to avoid AI bias

Avoiding bias in AI requires intentional action at every stage of the AI lifecycle. According to IBM, bias mitigation is most effective when it is part of a broader AI governance strategy that prioritizes fairness, transparency, and accountability throughout development and use. 

  • Build with diverse and representative data: Ensuring that training datasets reflect the full diversity of the population the system will serve helps prevent under- or mis-representation of groups that might otherwise be disadvantaged. This includes collecting data from a wide variety of demographic, cultural, and socioeconomic backgrounds so that the model doesn’t unintentionally favor one group over another. 
  • Detect and mitigate bias early: Implement continuous bias detection and mitigation tools, such as algorithmic audits, fairness tests, and human-in-the-loop processes where humans review and validate automated outcomes. Regular evaluations help catch and correct bias before it affects decisions in production. 
  • Promote transparency and explainability: AI systems can be complex “black boxes,” meaning it’s difficult to understand how decisions are made. Prioritizing transparency and interpretability, such as documenting how models are trained and explaining their logic, makes it easier to identify when and why bias occurs. Clear documentation also builds trust among stakeholders and end users. 
  • Design inclusively: Engaging a diverse, interdisciplinary team of developers, data scientists, domain experts, and representatives from affected communities brings varied perspectives to identify and address potential biases that a homogeneous team might miss. 
  • Govern AI across its lifecycle: AI governance establishes the rules, policies, and standards that guide responsible AI development and deployment. Organizations should create or use formal oversight frameworks, ethical guidelines, and conduct periodic reviews to ensure systems remain fair and compliant with evolving best practices and regulations. 
  • Include human oversight: Even highly automated systems benefit from human judgment. Human-in-the-loop mechanisms, where critical decisions are reviewed or approved by people, can act as a safeguard against automated errors and bias that the AI may miss.
